Restore Magicka isn't available to players as it would result in unlimited magicka because it costs less than it restores (it can be found in the editor).
Restore Fatigue can be found in the Temples and Imperial shrines.

Um I swear I sa a restore magic spare... maybe a fortify magic? Not sure.

You're probably thinking of Powerwell which is Fortify Magicka.
